Recent advancements in supervised RL have demonstrated remarkable ability to execute complex behaviors in real-world scenarios, from grasping objects to agile movements. However, the reliance on task-specific reward functions, often requiring extensive engineering, poses a limitation. Designing such rewards can be intricate, particularly in scenarios where additional sensors or manual task markers are needed. This prompts the exploration of unsupervised learning as a promising direction for RL, bypassing the engineering hurdles associated with reward engineering.

In supervised RL, an external reward from the environment guides agents towards desired actions, reinforcing behaviors that yield desired environmental changes. Unsupervised RL, on the other hand, employs intrinsic rewards like curiosity, allowing agents to generate their training signals without explicit task guidance. Intrinsic rewards offer a universal approach applicable to various agents and problems without extensive customization. Despite recent advances in unsupervised RL methods, the challenge remains – learning meaningful actions without environmental cues can be challenging.

DADS: A Breakthrough in Unsupervised Skill Discovery

Enter DADS (Dynamic and Differentiable Unsupervised Skill Discovery), a pioneering work that integrates the concept of 'predictability' into unsupervised learning. DADS assumes a fundamental characteristic of skills: they induce predictable environmental changes. By capturing this notion, DADS presents a novel algorithm that demonstrates its effectiveness in diverse simulated robotics environments. A follow-up study, "Unsupervised Off-Policy Reinforcement Learning for Real-World Robot Skills," further improves DADS' sample efficiency, proving its viability in the physical world.

DADS ingeniously designs an intrinsic reward function that rewards agents for discovering skills that are both predictable and diverse. It judges a skill's predictability by training a skill dynamics network that forecasts environmental state changes given the skill and current state. The better the prediction, the more "predictable" the skill. This reward function, adaptable to traditional RL algorithms, fosters agents to capture a broad range of potentially valuable behaviors.

What sets DADS apart is its ability to model-based control using the learned skill dynamics. Predicted state transitions from each skill can be combined to simulate trajectories, eliminating the need for real-world execution. This enables efficient task-solving by selecting the optimal skill for a given objective without extra training.

Real-World Success

While demonstrations in real-world robotics are scarce for unsupervised learning, DADS pushes the boundaries. The "Emergency Real-World Robot Skills via Off-Policy Unsupervised Reinforcement Learning" showcases the improved sample efficiency of off-DADS, a refined version of the initial algorithm. With off-policy learning, D’Kitty, a quadruped from ROBEL, learns complex behaviors like varied gaits and directions, all initialized with random strategies and no explicit environmental rewards.

Looking Forward

Our contribution with DADS opens new avenues for future research. Exploring the correlation between state representations and DADS-discovered skills could lead to learning state encodings that encourage skills beneficial for downstream tasks. Separating high-level planning from low-level control, as in skill dynamics, could be a key area of investigation for its universal applicability in reinforcement learning challenges.
